ETH: Data-Balanced Heterogeneous Pipeline Parallelism for Training Large Models

The paper introduces ETH, a training system that implements Heterogeneous Pipeline Parallelism (HPP) to achieve fine‑grained data balance across heterogeneous pipelines. ETH uses a hierarchical workload balance framework and block‑wise gradient aggregation to reduce communication overhead, while also providing optimizations that cut configuration search time. Experiments show ETH can double training speed and cut configuration generation overhead by up to 56× compared to existing systems.

Para-Pipe: Exploiting Hierarchical Operator Parallelism of ML Computational Graphs on SoCs

Para-Pipe is a hierarchical mapping framework that integrates intra- and inter-stage operator parallelism within a pipelined architecture for machine‑learning computational graphs on heterogeneous System‑on‑Chip (SoC) platforms. By selectively fine‑tuning parallelism levels across pipeline stages, it navigates the trade‑off between throughput and latency, reducing inter‑processor communication overhead and improving energy efficiency. Evaluation on Amlogic and Black Sesame SoCs shows multiple Pareto‑optimal configurations, with throughput‑optimized setups achieving up to 11.0% better energy efficiency than purely pipelined strategies and 23.3% better than non‑pipelined parallel execution.

DynaFlow: Transparent and Flexible Intra-Device Parallelism via Programmable Operator Scheduling

DynaFlow is a framework that enables transparent and flexible intra‑device parallelism by separating logical model definitions from physical execution schedules. It offers a flexible frontend with annotations for graph partitioning and a programmable interface for custom parallelism strategies, while its efficient backend handles asynchronous control/data‑flow, custom memory management, and remains compatible with CUDA Graphs and TorchInductor. The authors demonstrate that DynaFlow can integrate representative parallelism strategies into six state‑of‑the‑art ML systems with minimal code changes, achieving up to a 1.29× throughput improvement.

Para-Pipe: Exploiting Hierarchical Operator Parallelism of ML Computational Graphs on SoCs

Para‑Pipe is a hierarchical mapping framework that combines intra‑ and inter‑stage operator parallelism within a pipelined architecture to optimize deep‑learning inference on heterogeneous System‑on‑Chip (SoC) platforms. By selectively tuning parallelism levels across pipeline stages, it balances throughput and latency while reducing inter‑processor communication overhead. Evaluations on Amlogic and Black Sesame SoCs show Pareto‑optimal configurations, with throughput‑optimized settings achieving up to 11.0 % higher energy efficiency than purely pipelined approaches and 23.3 % over non‑pipelined parallel execution.

PipeLive: Efficient Live In-place Pipeline Parallelism Reconfiguration for Dynamic LLM Serving

PipeLive introduces a method for live, in‑place reconfiguration of pipeline parallelism in large language model serving. By redesigning the KV cache layout and extending PageAttention, it enables dynamic resizing of the cache without interrupting inference. The system also uses an incremental KV patching mechanism to keep KV states consistent during reconfiguration, achieving significant reductions in reconfiguration time and improvements in latency metrics.
