TUON: A Tensor-Aware Optimizer Utilizing Tensor-SVD and Polarization for Large Language Model Pretraining

The paper introduces TUON, a tensor‑aware optimizer that leverages Tensor‑SVD and a unitary transform to mix and polarize layers, thereby capturing cross‑layer correlations while preserving per‑layer diversity. Unlike previous matrix‑aware optimizers such as Muon, TUON avoids structural imbalance and misalignment caused by unfolding, enabling scaling to more layers and diverse modules beyond QKV. The authors prove that TUON performs steepest descent under a transformed tensor spectral norm, establish theoretical properties relative to Muon and TEON, and demonstrate empirical improvements on GPT‑124M/350M and Qwen‑0.6B/4B models.

Tensorion: A Tensor-Aware Generalization of the Muon Optimizer

arXiv:2606. 25975v1 Announce Type: new Abstract: Common first-order optimizers, such as Adam, implicitly treat each parameter block as an unstructured vector, which disregards the multilinear weight structure present in many modern machine learning models.

Optimizing Large Language Models with Chained LMOs

The paper introduces chained linear minimization oracles (chained LMOs) as a unified framework for optimizers that compose multiple matrix normalizations, addressing fragmentation in the field. It shows that while many such chains can diverge on smooth convex objectives, chaining can still improve performance under anisotropic embeddings, as demonstrated by the new TensorChain optimizer. TensorChain, which stacks compatible weight matrices across layers and normalizes a 3‑D tensor, achieves a 9.6% token efficiency gain over Muon in Qwen3 0.6B and 1.7B pretraining at matched validation loss.

Tensor Methods for Language Models: From Token Representation to Training, Adaptation, Inference, Compression, and Interpretability

This survey reviews tensor methods applied to large language models, framing them through a seven‑stage lifecycle (tokenization, embeddings, pre‑training, adaptation, compression, inference, interpretability) and a component view (embeddings, attention, feed‑forward networks). It offers unified notation, theoretical foundations, and comparative analyses of tensorization strategies for Transformer components, while highlighting evaluation protocol differences and model scale effects. The paper also introduces a new metric, ρ_gap, to quantify the gap between theoretical memory savings and actual system‑level speedup, and connects tensor techniques to related efficiency and probabilistic methods.

LORA-CRAFT: Cross-layer Rank Adaptation via Frozen Tucker Decomposition of Pre-trained Attention Weights

arXiv:2602. 17510v2 Announce Type: replace-cross Abstract: We introduce LoRA-CRAFT (\textbf{C}ross-layer \textbf{R}ank \textbf{A}daptation via \textbf{F}rozen \textbf{T}ucker), abbreviated CRAFT throughout, an extremely parameter-efficient fine-tuning (PEFT) method that applies Tucker tensor decomposition to pre-trained attention weight matrices stacked across transformer layers and trains only small square adaptation matrices on the resulting frozen Tucker factors.

Activation-Aware Weight Tensorization: A Calibration-Time Preconditioner for Tensor-Network LLM Compression

Activation-Aware Weight Tensorization (AWT) is a training‑free calibration wrapper that preconditions each weight matrix with a diagonal activation‑derived scale before applying standard Tensor Train (TT) or Tree Tensor Network (TTN) decompositions. By adding only an input‑side elementwise rescaling, AWT improves functional fidelity of post‑training tensor‑network compression across several large language models (Llama 3.1 8B, Ministral 8B, Qwen2.5 7B) at 2–6× compression, closing a significant portion of the perplexity gap to dense baselines and enhancing downstream task performance. The method demonstrates that diagonal preconditioning offers a robustness‑modularity trade‑off, outperforming full‑covariance oracles in many cases while remaining modular and solver‑agnostic.
