Beyond Deduplication: Sharp Retrieval Limits for Attention with Correlated Distractors

Read the original on arXiv Machine Learning →

The paper studies how redundant context influences attention mechanisms, distinguishing between normalization effects from repeated items and score variability within correlated groups. Using a planted retrieval model with exponentially many Gaussian distractors organized into large clusters, the authors derive exact retrieval thresholds via a two‑level generalized random energy model and Gaussian interpolation. They show that subtracting the log cluster size from pre‑softmax scores removes multiplicity but fails to eliminate extreme within‑cluster scores, establishing a sharp limit on signal strength that cannot be overcome by temperature scaling alone; averaging scores before exponentiation mitigates this effect but only when the relevant item is a singleton.

Stratified Sparse Attention: Reducing the Sparse-to-Dense Gap at Extreme Sparsity

The paper introduces Stratified Sparse Attention (SSA), a framework that blends deterministic top‑k retrieval with score‑guided sampling to reduce the gap between sparse and dense attention in large language models. SSA attends to high‑scoring tokens deterministically while sampling the remaining attention mass using proxy scores, thereby recovering more of the attention distribution. Experiments on benchmarks such as RULER, LongBench, LOFT, and AIME show that SSA outperforms existing sparse methods across models ranging from 3B to 27B parameters, achieving significant accuracy gains and up to 2.96× decode speedup with optimized CUDA kernels.
